'Let's think step by step' was a magic phrase for early LLMs \(GPT-3\) to unlock zero-shot Chain of Thought. Modern models inherently reason, and using the old phrase often results in pedantic, shallow preambles where the model explains obvious steps while skipping complex ones. Structured reasoning directives force the model to allocate compute to the actual hard parts of the problem.
